0x01 前言
通讯模块代码位于:runtime/communication.py。我们首先思考一下,通信模块需要哪些功能?

阶段(Stage)之间的通信,如果阶段在不同机器上如何处理?在同一个机器上如何处理?
-
因为是异步通信为主,不同节点的性能可能不同,是否需要一个缓存机制来协调不同节点,类似背压功能?
-
深度学习参数众多,涉及的张量和梯度众多,层数众多,每层的数据并行数目也不同,所以前向传播和反向传播如何保证按照确定次序运行?
-
因为节点上需要进行前向,后向传播,所以需要建立多个线程进行分别传输。
因此我们下面分析时候,就结合这些问题进行思考。
0x02 类定义
CommunicationHandler 负责在阶段(Stage)之间的通信。
- 如果阶段位于不同机器上,就使用 PyTorch p2p 的 send/recv。
- 如果阶段位于同一个机器上,则使用 PyTorch p2p 的 broadcast。
下面代码中,主要就是初始化各种成员变量,我们目前最熟悉的是和DDP相关的,比如init_process_group。

0x03 构建
3.1 初始化
前面章节中提到,当生成了CommunicationHandler之后,会调用initialize进行初始化。

- 构建通信需要的queue。
- 构建发送消息的次序。

我们具体分析如下。
3.2 创建queue
Queue 的作用是作为 send,receive 的基础,系统通过index找到哪一个queue,然后进行相应操作。
initialize 函数传入了两个ranks列表。
- receive_ranks 就是本节点的输入rank。
- send_ranks 就是本节点的输出rank。
ranks 列表举例如下:

setup_queues 相应一共建立了4个queue列表:
- forward_receive_queues :前向传播过程中,接受张量的queue。对应了 receive_ranks。
- backward_send_queues : 后向传播过程中,发送张量的queue。对应了 receive_ranks。因为前向传播中接受的对象,就是后向传播中发送的目标。
- forward_send_queues : 前向传播过程中,发送张量的queue。对应了 send_ranks。
- backward_receive_queues :后向传播过程中,接受张量的queue。对应了 send_ranks。因为前向传播中发送的目标就是后向传播中接受的对象。
大致逻辑如下:

以 forward_receive_queues 为例。
- forward_receive_queues 这个列表包括多个queue。
- receive_ranks 列表中包括多个 rank,每个rank在通信过程之中,对应了一个张量,可以认为 receive_ranks 包括多个张量,由一个张量名字来对应。张量名字类似于:target_tensor_names = {"target", "target_length"}。
- forward_receive_queues 列表之中,每一个queue对应了receive_ranks 之中的一个 张量。
- 每个张量,对应一个唯一的tag,PipeDream的目的是让每一个tag都有自己的process group,因为任何一个stage都有可能并行。
- 针对这个张量和这个唯一的tag,注册 [tag, rank] 到 connection_list。

3.3 前向后向顺序
接下来建立消息传递的前后向顺序,其目的是为了让每个 worker 记录如何处理由前向层/后向层传来的rank。
3.3.1 建立顺序
setup_messaging_schedule 方法就是用来建立:
- 前向传播时接受的顺序。
- 后向传播时发送的顺序。
这里的重点是:如果前一层数目比本层数目多,就把 i对应的前一层rank
和 i + (本层rank数目) * n 对应的前一层rank
都加入到本层 i 的计划(self.message_schedule)。n 等于 num_ranks_in_stage。
最终把顺序放入 self.messaging_schedule 成员变量。假如本stage是拥有 3 个rank,则 self.messaging_schedule 就是这三个rank 分别的 message_schedule,每个 message_schedule 里面都是对应的上一层 某些 ranks。
再细化一下:
- self.messaging_schedule 是一个列表。
- self.messaging_schedule 其中每一个item又是一个列表。self.messaging_schedule[ i ] 就表示比如 本层 第 i 个 rank 对应的 schedule(message_schedule)。
- schedule(message_schedule)是上一层 或者 下一层 的某些ranks。
- message_schedule包括的ranks是本stage所包括ranks的一个index。因为是内部使用,所以不需要是真正的 rank 数值,只要能和内部的queue等其他内部数据结构映射上即可。

3.4 建立进程组
目的是:针对每个张量,设置两个进程组,一个用于前向,一个用于后向。每一个张量有一个自己的tag。每一个tag都有自己的两个process group,因为任何一个stage都有可能并行。
3.4.1 设计
首先,我们看看注释,学习一下为何这么设计。
create_process_groups 方法在所有rank之中以同样顺序建立进程组。为了以同样顺序建立进程组,每个worker都会收集其他所有workers的connection_list(GPU to GPU)。为了做到这一点,每个worker收集所有其他workers的连接列表connection_list(L)的最大大小。然后每个worker创建一个大小为Lx2的张量,其中每行表示一个连接,并根据“它本身连接列表大小”来填充此张量。拥有最大连接列表的worker将填充整个张量。
构建此列表后,将执行all_gather操作,然后每个worker都拥有一个相同的 NxLx2 输出,其中N是worker 数量(world_size),输出的每个index代表一个worker的连接列表。对于 i=self.rank,输出将与本worker的本地连接列表相同。
每个worker以相同的顺序在连接列表上进行迭代,检查是否已创建每个连接(每个连接都将在输出中出现两次),如果连接不存在,则对于前向和后向都创建一个新的进程组。既然在进程组中rank永远是一致的,所以小rank排在前面,大的rank排在后面。
3.4.2 代码
回到代码上,我们仔细分析下。

这里就用到了 connection_list。具体逻辑是:
- 找到 workers 之中最大的 connection_list
- 获取到 connection_list 的大小,即 connection_list_size
- 用集合通信来对 connection_list_size 进行聚合,最后得到的gathered_connection_list_sizes就是所有节点上的 connection_list_size 集合
- 得到connection_list的最大数值
- 利用最大数值来构建张量列表 connection_list_tensor
- 把张量移动到GPU之上
- 用集合通信来对 connection_list_tensor进行聚合,得到aggregated_connection_list
- 在每个worker之上,利用 dist.new_group 建立同样的进程组
- 遍历aggregated_connection_list中的每一个connection
- 得到张量对应的tag
- 针对每个张量,设置两个进程组,一个前向,一个后向
因此,目的就是在每个 worker 之中建立同样的进程组,针对每个张量,设置两个进程组,一个前向,一个后向。

0x04 功能函数
以下功能函数就是最终被使用完成 流水线 RPC 逻辑的函数。
这里有一个通过queue完成的解耦合:
- recv 和 send 就会对于 queue 进行操作,往queue里面添加或者提取张量。
- 助手线程会调用 _recv 和 _send 对 queue 进行操作。
所以我们要先看看这个Queue的实现,可以看到,无论是 add 还是 remove,都使用了 threading.Condition,就说明几个线程可以在 Queue 上通过 add / remove 实现等待,阻塞,即生产者和消费者。

4.1 发送逻辑
发送的逻辑如下:
- 训练代码会调用StageRuntime.run_backward。
- StageRuntime.run_backward 方法会调用 StageRuntime.send_tensors_backward 来发送张量 tensor_name。
- send_tensors_backward 会调用 CommunicationHandler.send 来向 CommunicationHandler 的成员变量backward_send_queues[tensor_name] [index] 添加这个张量。每个张量对应了若干个queue。这里就是个解耦合。
- send 函数 会调用 backward_send_queues.add,这里会通知阻塞在queue上的 send_helper_thread 进行工作。
- 在 CommunicationHandler 的线程 send_helper_thread 中,之前就阻塞在queue这里,此时会从 backward_send_queues[tensor_name] [index] 之中提取张量。
- send_helper_thread 会调用 _send 来发送张量。
- 而最终调用的是 dist.send,就是PyTorch P2P。

4.2 接受逻辑
接受逻辑如下:
- StageRuntime 训练代码中调用 run_backward。
- run_backward 调用 receive_tensors_backward。
- receive_tensors_backward 调用
self.gradients[output_name] = self.comm_handler.recv
获取梯度。CommunicationHandler 的 recv 函数会阻塞在backward_receive_queues[tensor_name] [index]
之上。 - 同时,CommunicationHandler 的 recv_helper_thread 线程调用 _recv 接受其他stage点传来的张量。
- _recv调用 dist.recv 或者 dist.broadcast 接受张量。
- _recv 向 backward_receive_queues[tensor_name] [index] 添加张量。这样就通知阻塞的 CommunicationHandler 的 recv 函数进行工作。
- CommunicationHandler 的 recv 函数会从backward_receive_queues[tensor_name] [index] 提取梯度,然后返回给 StageRuntime。就是 3 的返回。
